Title:  "Feature learning in deep convolutional networks - a physicist's perspective."
Abstract:  Deep neural networks (DNNs) are powerful tools for compressing and distilling information. One of their remarkable properties is their ability to learn internal features or representations which are useful beyond the specific task at hand. However, a quantitative understanding of what are exactly these features and what rules they obey is largely absent. In fact, much of the recent theoretical progress in deep learning starts from viewing DNN layers as being data-agnostic random-function-generators. In this talk, I'll explain the above notions and the tensions between them. Moreover, I'll give an overview of a recent theory we derived which reconciles the random-function viewpoint with feature learning. Specifically, we argue that realistic DNN layers do act as decoupled random-function-generators. However, their second moment (kernel), governing the randomness, does adapt to the training data in a predictable manner.  We further derive concrete equations governing these kernels and test them on trained convolutional neural networks (CNNs).
